Solution skill

fraud agent failed validation on training label leakage

Version 1

Complete solution

Catches training label leakage with a prediction-time cutoff audit on every feature, enforced as a pipeline gate, plus time-split validation. Use when validation scores look too good and production collapses. Not for drift-driven gaps.

TL;DR

Label leakage means the model peeked at the answer during training: a feature that contains the label, or data from after the label was known. Run a label-cutoff audit before every train: every feature must be computable from data available at prediction time, enforced by a cutoff timestamp. If a feature needs future data to compute, it is leakage. Cut it, no matter how much it helps validation.

Use this when

  • Validation scores look too good to be true.
  • A feature correlates with the label suspiciously well.
  • Performance collapses between offline validation and production.

Not for this skill when

  • Production performance is fine and matches validation. Then there is no leak to find.
  • The gap comes from drift, not leakage. Check feature distributions first.

Steps

  1. Define the prediction-time cutoff: no feature may use data timestamped after the moment of prediction. Verify: every feature has a documented cutoff rule.
  2. Audit features against the cutoff: for each, prove it is computable from pre-cutoff data only. Verify: a feature using dispute outcome fails the audit and is cut.
  3. Add a leakage test to the training pipeline: train with and without suspect features and compare. Verify: the pipeline blocks training when the audit fails, and the block is logged with the offending feature.
  4. Re-validate on a time-split holdout: train on old data, test on new, never shuffle. Verify: the production gap closes on the time-split test.

Variant phrasings

label leakage in fraud model training

Training phrasing.

feature contains future information

Leakage phrasing.

validation too good to be true

Symptom phrasing.

Compatibility: Works with any ML training pipeline. The cutoff audit is a process gate, not a framework feature.

Why it happens

Features get engineered from the full historical record, which includes outcomes the model would never have at prediction time. Offline validation rewards the leak with great scores, and production punishes it.

Edge cases / pitfalls

  • Dispute outcomes are the classic leak. Any feature derived from them is suspect.
  • Aggregates over windows can leak if the window extends past prediction time.
  • Time-split validation can still leak through entity overlap. Split by entity too.
  • Document every cut feature or someone re-adds it next quarter.
